Quantum-Enhanced Large Language Models: When Transformers Meet Quantum Computing

The open-source project "quantum-llm-agent" explores integrating quantum circuits into the core components of the Transformer architecture. Through innovations like hybrid quantum-classical attention mechanisms and adaptive qubit routing, it builds a complete, runnable hybrid model, bringing a new computational paradigm to language models. Currently running on simulators, it is already adapted for future quantum hardware deployment needs.

Quantum computing and deep learning have long developed independently— the former promises to solve classical challenges, while the latter has made breakthroughs in multiple fields. This project aims to break down barriers by integrating quantum circuits into the core of LLMs. It is not just a proof of concept but a runnable hybrid quantum-classical model, preparing for future deployment on real quantum hardware.

The layered architecture enables collaboration between quantum and classical components:

• Embedding layer combines classical word vectors with quantum feature mapping;
• Position encoding overlays classical sine encoding with quantum angle encoding;
• Quantum multi-head attention replaces some classical heads (6-12 qubits), using a trainable router to dynamically select quantum experts (MoE design);
• Feedforward network runs classical GELU and quantum activation circuits in parallel.

Key technical breakthroughs:

• Automatic differentiation via PennyLane allows quantum circuit parameters to be optimized collaboratively with classical weights;
• Self-developed NumPy fast simulator is 14x faster than PennyLane's default;
• Supports PennyLane-Lightning backend, reducing each training step to ~50ms on NVIDIA GPUs, enabling practical training.

Quantum-enhanced agent workflow components:

• Reasoning module uses quantum superposition to explore multi-path solutions and interference effects to optimize answers;
• Memory module adopts quantum associative memory, leveraging entanglement for fast retrieval;
• Multi-agent coordination module explores quantum entanglement's potential in distributed communication (currently simulated with expansion space reserved).

Code implementation details:

• Divided into four modules: quantum components, classical components, hybrid integration layers, and agent workflows;
• Classical components are implemented with NumPy (no PyTorch dependency);
• Includes 50 test cases covering unit/integration tests, gradient flow validation, and performance benchmarks to ensure component collaboration and model convergence.

Research significance and future directions:

• Provides a runnable platform to validate architectural designs and training algorithms;
• Future work: explore complex dependency capture in quantum attention, efficient quantum memory retrieval, and multi-agent entanglement coordination;
• Serves as a research prototype to accumulate experience for post-quantum hardware applications.

This project represents a frontier direction in AI. While it has not yet achieved quantum advantage, it proves the feasibility of hybrid quantum-classical methods.
