### Discrete Diffusion Models Adapted to Discrete Structured Data
Traditional diffusion models are designed for continuous data, while discrete diffusion models adapt the diffusion process to discrete spaces (such as program code, logical expressions, planning schemes, etc.), learning to reverse the process to recover legal structures through a noise process of random replacement/insertion/deletion of discrete elements. Their advantages include progressive correction, uncertainty modeling, and bidirectional context utilization.
### Introduction of Neurosymbolic Constraints
The core innovation of the project is integrating neurosymbolic predictors, which limit outputs through syntax constraints (ensuring code syntax correctness), semantic constraints (differentiable logic layers ensuring logical relations), and domain constraints (professional rules); it uses techniques such as continuous relaxation, constraint propagation, and energy functions to implement differentiable symbolic reasoning.

### Program Synthesis
The generated code is almost 100% syntactically correct, and supports progressive interaction and uncertainty expression (showing the distribution of the solution space when multiple feasible solutions exist).
### Mathematical Reasoning
By encoding mathematical axiom systems as constraints, it ensures that derivations are based on legal axioms/theorems and consistent in type, and the generated proofs can be checked by external verifiers (such as Lean, Coq).
### Planning and Decision Making
It generates action sequences that satisfy state constraints, goal orientation, and resource limits, and uses conditional diffusion to guide trajectories toward target states.

### Scalable Learning
The modular architecture allows independent expansion of neurosymbolic predictors; symbolic constraints serve as a strong inductive bias to reduce reliance on large-scale labeled data, and reasoning capabilities can be transferred to related domains.

The diffusion process naturally provides uncertainty estimation, showing higher uncertainty for difficult samples; it supports rejecting predictions or requesting human intervention; temperature scaling is used to ensure that confidence matches actual accuracy.

### Current Limitations
High computational overhead (multi-step iteration is slower than single-step generation), limited constraint expressiveness (difficult to efficiently encode complex higher-order logic constraints), and insufficient training stability (requires careful parameter tuning).
